But that recipe hides an assumption nobody states out loud: that you can train long enough. Almost nobody can afford that.

A team from Alibaba Group and the University of Michigan arrives at a counterintuitive fix. Instead of finding a stronger teacher, they find a weaker one and use it to show where the stronger model is still underfit, then shift the regression target one step in the opposite direction. The paper is called SWIFT, arXiv 2610.25844, submitted on 19 October, 38 pages including appendices (https://arxiv.org/abs/2610.25844).

## The gap is not random, and a weak model can see it

The ideal target for a diffusion model is the posterior mean; the sampler assumes the denoiser it is trained with actually is that mean. Training budgets are finite, so the denoiser you end up with falls short.

The key observation is that this shortfall is not random noise. Models of the same kind, trained the same way, learn the same components slowly, so they fall short in the same direction. A weaker such model, smaller or stopped early, falls further along that same direction, and its prediction effectively writes out where training will miss. Once you know which way it errs, you can aim in the opposite direction.

The method changes exactly one thing: what the denoiser is asked to predict. The loss, the weighting, the architecture and the sampler all stay put. The regression target becomes x0 plus alpha times x0 minus the weak model's prediction, where alpha sets the extrapolation strength; setting alpha to zero recovers ordinary training. The mean of this target is one plus alpha times the posterior mean minus alpha times the weak prediction, which pushes the target past the clean sample on the side away from the weak model, precisely opposite to where the model is underfit.

## The numbers: all 18 configurations improve

On ImageNet-256 the paper uses one fixed recipe with alpha set to 0.4 and no tuning. Across 18 DiffusionBench configurations, spanning VAE latents, representation-autoencoder latents, end-to-end learned latents and pixel space, unguided FID drops in every case by 16% to 49%, with a 31% median. At the best available guidance settings, guided FID drops in all 18 as well.

The matched pairs are as follows. Same architecture, schedule and sampler; only the regression target differs.

- RAE/DINOv2-B: 2.09 down to 1.75, a 16% drop; guided, 1.98 down to 1.59
- VAE/SD-VAE: 5.49 down to 3.77, a 31% drop; guided, 2.32 down to 1.81
- End-to-end/Qwen-VAE: 4.94 down to 3.23, a 35% drop; guided, 1.50 down to 1.40
- Pixel/PixNerd: 20.37 down to 10.31, a 49% drop; guided, 4.17 down to 3.38
- RAEv2/DINOv3-L (875M, up to 160 epochs): 1.56 down to 1.15; guided, 1.04 down to 0.99

On the strongest configuration, RAEv2, FID 1.15 arrives without inference-time guidance at all, and 0.99 with it.

## The cost ledger: 9% more training, about half the compute

The weak guide defaults to roughly a quarter of the main model's parameters, trained for half as long, and runs without gradients, adding about 9% FLOPs per training step. In the DiffusionBench configuration the guide's forward pass costs about 26% of the main model's, 87.3 against 337.5 GFLOPs per sample, while a baseline update is about three forward-equivalents. So an update costs roughly 1.09 times the baseline. Add the one-off cost of pretraining the guide at about 10.4 baseline-equivalent epochs, and charge all of it to a single 80-epoch run, and the total lands near 1.22 times an 80-epoch baseline.

After training, the guide is simply discarded. Sampling stays a single network with the original sampler, and there is no inference overhead.

The genuinely counterintuitive part shows up over longer runs. On DINOv2-B, SWIFT crosses the baseline's best score of 1.53 achieved at 320 epochs by epoch 120, reaching 1.50 itself, while using 0.45 times the training FLOPs. On DINOv3-L it happens earlier still: 1.34 at epoch 50 already beats the baseline's 1.56 at epoch 160, at 0.44 times the FLOPs.

## A few limits worth noting

The paper is explicit about this: the target is biased on purpose, and with unlimited training SWIFT would end up worse than ordinary training. The entire gain comes from the finite budget. The theorem guarantees distance to the posterior mean, not FID itself.

On ablations, alpha between 0.4 and 0.8 works well and the curve is U-shaped, with overshoot if you push it too far. The guide should be weaker but competent; a half-width guide works best, taking CIFAR-10 FID from 2.58 down to 1.60 compared with a full-width one, and much smaller guides hurt. Past a competence threshold, how long the guide trains hardly matters. Frozen is enough, and co-training the guide showed no clear additional benefit.

The algebraic form is in fact the same as autoguidance, a strong model minus a weak one. The difference is that autoguidance does this at every sampling step, while SWIFT turns it into the training target and adds nothing at inference.

## So what

The interesting part of this paper may not be yet another score improvement, but the idea that the regression target is itself a design variable. Most image-model tuning effort goes into architecture, data and samplers, while the objective keeps getting copied from the standard recipe. Under realistically bounded budgets, the weaker model you already have turns out to be a piece of information about what is missing.

The first author claims state-of-the-art generation quality in the comments on the Hugging Face paper page.
